Mitigating Model Drift: Building Continuous Training Pipelines on Kubernetes
Detecting data and concept drift and automating safe retraining and promotion on Kubernetes.
Every deployed model starts decaying the day it ships. Customer behavior shifts, upstream schemas change, and fraudsters adapt. Continuous training (CT) turns retraining from a quarterly fire drill into an automated, governed loop.
Types of drift
- Data drift: input feature distributions change (measured via PSI, KL divergence, or KS tests).
- Concept drift: the relationship between inputs and labels changes — visible only once labels arrive.
- Upstream breakage: null spikes or unit changes from a source system — catch with schema contracts.
Pipeline design
Monitor ─► Drift threshold breached ─► Trigger pipeline (Argo/Kubeflow)
─► Pull fresh labeled data ─► Train ─► Evaluate vs champion
─► Gate: metrics + fairness + latency ─► Shadow ─► Canary ─► PromoteKubernetes specifics
Run training as Kubernetes Jobs on dedicated GPU node pools with taints and tolerations. Use spot instances with checkpointing for cost efficiency, and Kueue or Volcano for fair queueing across teams.

A retrained model must beat the current champion on a frozen evaluation set and a recent-traffic set, without regressing fairness or latency. Automate the comparison and require human sign-off for high-risk models.
Rollback is a feature
Keep the previous champion warm. If canary error rates or business KPIs degrade, traffic shifts back automatically within seconds.
